Machine learning engineering connects experimentation to dependable systems. It includes data contracts, reproducible training, evaluation, packaging, deployment, monitoring, and iteration—not only selecting a model architecture.
The Scientific Python Foundation #
NumPy provides the core multidimensional array type and numerical operations. SciPy builds on NumPy with algorithms for optimization, statistics, signal processing, and scientific computing. Scikit-learn provides accessible implementations of classical machine-learning models, preprocessing, model selection, and evaluation tools.
python -m pip install numpy scipy scikit-learnUse virtual environments and lock dependency versions for repeatable work. NumPy, SciPy, and scikit-learn are separate projects with complementary scopes.
Deep Learning and Model Libraries #
PyTorch provides tensors, automatic differentiation, neural-network modules, and distributed training primitives:
python -m pip install torch torchvisionHugging Face Transformers supplies implementations and loading utilities for many pretrained architectures. It is often paired with PyTorch, but it does not replace understanding a model’s tokenizer, configuration, or licensing terms.
Inference engines such as vLLM, TensorRT-LLM, and Text Generation Inference focus on efficient serving. Training frameworks such as DeepSpeed, FSDP, and PyTorch Lightning address different concerns. Choose components for the workload rather than treating them as interchangeable model libraries.
Model Artifacts and Safety #
Common artifact formats include NumPy .npy arrays, PyTorch checkpoints, and safetensors files. Python pickle-based formats can execute arbitrary code during loading, so never unpickle an artifact from an untrusted source. safetensors is designed to store tensors without that execution behavior.
An Engineering Workflow #
Start with a measurable product objective and a representative evaluation set. Version data, code, configuration, and model artifacts together. Before deployment, test latency, memory use, failure modes, and behavior on slices of the population that matter to the application. After deployment, monitor data drift, quality signals, cost, and regressions, then retain a safe rollback path.
